The LLM paradox: Balancing general knowledge with business acumen

State-of-the-art LLMs are immensely powerful generalists. They have been trained on a vast dataset and can converse on everything from ancient history to modern coding techniques. While this enables the AI to “understand” language and concepts broadly, it doesn’t guarantee a nuanced, context-rich understanding of your industry, company, and data. 

So, how do we balance an LLM’s broad general knowledge with a given business's specific insights and context? LLM capabilities and limitations

LLMs have demonstrated remarkable capabilities that make them attractive for enterprise use. 

Key strengths of LLMs include:

  • Language parsing and content generation- LLMs excel at parsing human language and generating coherent, contextually relevant responses. They can answer questions, summarize documents, and even write syntactically correct code in response to prompts.
  • Broad general knowledge- Because they are trained on diverse internet-scale data, LLMs carry a wealth of general knowledge. They “know” facts, definitions, and language patterns from many domains (science, finance, literature, etc.) up to their training cutoff.
  • Pattern recognition- LLMs can recognize patterns in text and perform forms of reasoning or inference. For example, they can follow instructions, translate languages, or complete a user’s sentence based on context.

However, alongside these capabilities come limitations that can create business risk and hamstring AI initiatives:

  • Limited context for domain-specific topics- An off-the-shelf LLM doesn’t know your company’s proprietary data, internal terminology, or the nuances of your business processes. It operates on generic training data, which means it won’t know what “Nike's Q4 sales” were unless that information is provided or publicly available.
  • Hallucination risk- When faced with questions about specifics it doesn’t know, an LLM may produce an answer that sounds plausible but is actually fabricated. This phenomenon is known as hallucination​. LLMs may invent a data point or misstate how a metric is calculated if it lacks a real reference. This undermines trust in the AI’s output.
  • Ambiguous guidance- LLMs can misinterpret ambiguous language without additional guidance. A prompt like “What was our growth last year?” could lead to confusion—does “growth” refer to revenue growth, user growth, or profit growth? Without clarity, the AI might pick the wrong one.

In practice, there are two broad approaches to bridge the gap between a general-purpose AI and a specialized domain:

  1. For example, specialized legal or medical LLMs have been developed because they outperform generic models in those domains​. However, this approach requires significant data, expertise, and computing resources to fine-tune effectively. Key dimensions of AI data readiness

Getting your data “AI-ready” isn’t a binary switch but a multidimensional effort. There are several key dimensions of data readiness that determine how well an AI system can work with your data. Think of these as facets of data quality and organization that particularly affect an AI’s ability to understand, navigate, and utilize the data. Below, we outline each dimension and explain why it matters.

Schema complexity

Schema complexity refers to how complicated your data model is – the number of tables or datasets, how they are related, and how easy it is to understand the overall structure. In a simple world, you might have one table with all the data you need, but businesses often have hundreds of tables or a web of data sources. High schema complexity can impede AI readiness in several ways. Firstly, a very complex schema is harder to navigate. If answering a simple question requires joining five tables, each with cryptic names, the chances of error increase. Secondly, complexity often correlates with redundancy or legacy baggage – old tables that haven’t been deprecated or multiple tables storing similar information. An LLM might be unsure which source to use. 

WisdomAI’s context layer can mitigate some schema complexity by surfacing the most relevant parts of the schema to the AI. For example, it can store that “for sales data, table X is primary” so that the AI focuses on that table. It can also hide some complexity behind simpler semantic concepts. For instance, if you have a column CTR, metadata might tell the AI this stands for “Click-Through Rate (%) for ad campaigns”. Without that, the model might guess or confuse it with something else. In many organizations, metadata is incomplete. Perhaps only some tables have descriptions, or the documentation is outdated. Improving metadata coverage is often a low-hanging fruit in data readiness. Modern data catalogs or governance tools can help automate some of this, but even manually, it’s worth prioritizing documentation for the most critical datasets.

Likewise, one team might call a metric “Annual Recurring Revenue” while another labels the same concept “ARR” or “Yearly Sales”. These inconsistencies can confuse an AI model and humans alike. Naming consistency applies to database schemas (tables/columns) as well as business terminology. Lack of consistency often arises from siloed development or mergers.

How does the context layer help? The context layer can act as a Rosetta Stone for your naming variations. It can learn that “client”, “customer”, and “account” are used interchangeably in different datasets and ensure the AI knows they refer to the same concept. Relationship clarity

Data tables relate to one another. Relationship clarity refers to how well-defined and transparent these relationships are in your data architecture. In a highly ready dataset, you know exactly how to join tables to get a complete answer: primary keys and foreign keys are in place, many-to-many relationships are resolved through junction tables, and there’s an entity-relationship diagram or data model that everyone follows. In less mature environments, relationships are implicit or poorly documented

For an AI system, unclear relationships are like missing puzzle pieces. If a question involves multiple entities (e.g., “sales by customer region”), the AI needs to know how Sales data connects to Customer data. Without clear relationships, the AI might attempt a join that yields incorrect results or might not find the connection at all. One specific challenge is when there are ambiguous relationship paths. If there are two possible ways to link tables (say, two fields that could be used as keys), a human modeler might test both or know from context which is correct. An unguided AI might choose the wrong path. That’s why ensuring a single source of truth relationship (or clearly indicating which path to use) is part of data readiness.

The WisdomAI context model will learn from any explicit relationships (like foreign key constraints or documented joins) and can even derive some relationship knowledge by analyzing data (for instance, noticing that customer_id in Table A has a matching pattern in Table B). It then uses this to inform the LLM. However, if relationships are not clear anywhere (no foreign keys, no documentation), even the context layer is operating with limited insight. Data trap presence

Data trap presence refers to the extent to which your data landscape contains pitfalls that can lead to misinterpretation or errors. These include classic schema traps like the fan trap and chasm trap (which are join patterns that produce incorrect results if not handled carefully​), business-specific traps like obsolete data that still looks valid, and double-counting issues with certain joins. 

In an ideal (AI-ready) scenario, data traps are eliminated or flagged. For example, a redesign might have removed a fan trap by restructuring the schema, or a particular table that teams should not use for new analyses is marked “deprecated”. In a chaotic environment, traps are everywhere: maybe a table combining product and sales data causes double counting because of how it’s keyed, but there’s no warning. For an AI, encountering a data trap can result in a hallucination. This can be dangerous in production – imagine an AI report doubling revenue due to a hidden fan trap. 

Therefore, part of data readiness is doing a trap audit to identify these pitfalls and address them. Common data traps to consider during an audit include: 

  • Fan trap- One common form where a one-to-many join combined with another one-to-many join yields an exaggerated result (common in star schemas if not modeled properly​.
  • Chasm trap- When two fact tables share a dimension but not in a straightforward way, leading to missing data if joining naively​.
  • Zombie data- Old records that should be excluded but aren’t flagged as such (e.g., accounts that have been deleted but remain in an export).
  • Overloaded fields- A single field whose meaning changes based on context (e.g., a “Type” column that has multiple uses). 
  • Timing mismatches- Data that isn’t aligned in time (e.g., fiscal year differences, or data updated at different cadences) can lead to traps where combining two sources gives a faulty timeline.

The context layer can learn to avoid documented data traps. WisdomAI’s context layer, by mining documentation, could catch notes like “Table B is deprecated, use Table C” and apply that knowledge. However, if traps are undiscovered or undocumented, the AI could stumble. Hence, improving this dimension often involves data modeling fixes or creating explicit warnings in your data catalog for certain objects.

Semantic ambiguity

Semantic ambiguity occurs when data fields or metrics can have multiple interpretations or when a single term means different things to different stakeholders. This is slightly different from naming inconsistency; even if names are consistent, their meaning might not be. For example, consider the term “Active Users.” Marketing might consider an “active user” as anyone who logged in in the last 30 days, while Product considers only those who performed a certain action. Both use the same term “Active User” but mean different things. If the AI is asked, “How many active users do we have?”, it’s ambiguous which definition to use. LLMs, being probabilistic, might pick one interpretation arbitrarily or give a blended answer that doesn’t cleanly match either definition. 

The context layer can detect ambiguity and either resolve it or seek clarification. For instance, if the user asks an ambiguous question, the system could follow up: “By ‘active users,’ do you mean last-30 days active or active as per product usage definition?” Under the hood, this is because the context model has captured that “Active User” is a term with multiple definitions in the company. Additionally, suppose one definition is far more common. In that case, the context might default to that, but still tag the answer with its understanding (e.g., assume marketing’s definition if 90% of past queries implied that). 

Grain level consistency

The grain of data refers to the level of detail at which data is recorded (daily vs monthly, individual transaction vs aggregated account, etc.). Grain level consistency means that when combining datasets or answering a question, you are aligning data at the proper level of detail. Inconsistency in grain is a common source of error.

In an AI context, grain issues manifest when the AI is asked something like, “What’s the average spend per customer per month versus the monthly target?” This requires careful aggregation: sum up per month per customer, then average, etc., and compare to a target that is monthly. If the grain isn’t managed, the AI might do an average of daily spend vs. monthly target, skewing the result.

Ideally, your queries and data models handle grain explicitly through grouping, or by using summary tables. Data warehouses sometimes have pre-aggregated tables for common grains (like a daily summary table or monthly summary table). Clearly stating the grain in metric definitions (e.g., “monthly churn rate is calculated on monthly cohorts”) also helps. 

The context layer can encode knowledge about grain. For instance, it can know that Table X is at daily grain, Table Y is at monthly grain, and how to roll up or down between them. If a user question spans grains, the context can assist the AI in formulating a step-by-step solution: maybe first aggregate daily data to month, then join to monthly targets.

These dimensions give you a checklist of sorts for data preparedness. Of course, not every organization will excel in all dimensions – that’s where the concept of stages of data readiness comes in.
